Rule-based, statistical and AI-driven scoring solve different problems and demand different levels of data maturity. A vendor-neutral look at when each approach is justified and when it becomes expensive theatre.

The scoring conversation in a bank often starts with the wrong question. Instead of «which task is currently under-served and what exactly do we need to solve», teams argue about which platform to buy: open source, commercial, cloud, with AI «out of the box», without AI. This shifts the focus from business to tools and turns the decision into a technology debate in which the main criterion — what kind of decision-making does the bank actually need for the next two or three years — gets lost.
A mature conversation about scoring does not start with the word «AI» or with a vendor name. It starts with an analysis of the current credit practice: which decisions are being made today, with what accuracy, on what data, with what level of explainability, at what speed and at what cost of error. Only then does it become clear which level of scoring machinery is actually needed — and which would just be a pretty picture.

If the bank is thinking about AI scoring but cannot answer, in fifteen minutes, «who owns the model», «how will we know it is drifting», «how will we retrain it if input data changes» and «how will we explain a specific decision to a customer and to the regulator», that is a signal that basic governance needs to come first — and more complex models should come later. Without that discipline, any model, even a simple one, becomes a source of hidden risk.

What is being compared
The scoring market splits neatly into three families, although in practice they often mix. The first is rule-based scoring, where the decision is built on explicit logical conditions and thresholds. The second is classical statistical scoring (most often logistic regression and its variations), built on historical data and validated with classical quality metrics. The third is AI-driven modelling: gradient boosting, neural approaches, alternative data sources, explainability through SHAP and similar techniques. These three approaches rarely compete for the same process — more often they compete for different tasks inside the same bank.
When option is justified:Rule-based
Rule-based scoring is justified in three situations. First, when the bank is only beginning to formalise its credit policy and cares more about transparency and manageability of the decision than about peak accuracy. Second, when the data required to train a statistical model is not yet mature enough, and any trained model would reflect noise rather than borrower behaviour. Third, when a set of decisions must — for regulatory or business reasons — remain fully explainable in terms of understandable rules, not model coefficients. The good news is that a well-built rule engine often delivers results surprisingly close to a simple statistical model, while staying manageable and transparent to the credit committee.
When option is justified:Classical statistics
Classical statistical scoring is the workhorse of most banks, and in most cases it still cannot be replaced by anything more complex. It is justified when the bank has accumulated enough credit history of good quality, has input data discipline, has stable customer segments and products, and when the team knows not just how to build a model but how to maintain, revisit and validate it. At that level of maturity a statistical model delivers stable results, verifiable quality metrics and predictable behaviour over time. For most Central Asian banks, this is exactly the level to treat as the base before even looking at AI.
When option is justified:AI-driven scoring
AI models are justified when the bank has already extracted value from statistical scoring, has data discipline, has a stable infrastructure for model retraining and monitoring, has a sufficient volume of labelled cases and has clearly defined tasks where a classical model really falls short. These are often short high-throughput scenarios — instant decisions on retail micro-loans, assessment of inactive customers through alternative signals, real-time anti-fraud. One important point: AI scoring requires its own governance layer. That means explainability, model inventory, change control, validation before production, drift monitoring, the ability to roll back. Without this discipline an AI model quickly becomes a black box that the bank can neither explain to the regulator nor control over time.
Common mistakes when choosing
- Starting the project from the word «AI» instead of from the question of which specific task is under-served by the current scoring
- Assuming that AI automatically improves decisions — without assessing the quality of the data the model will learn from
- Moving to a more complex model before mastering monitoring and validation of a simpler one
- Putting an AI model into production without per-decision explainability — and then having nothing to tell the regulator
- Ignoring governance: no model owner, no retraining procedure, no drift control
- Mixing AI scoring with bank marketing and forgetting that it is first and foremost an engineering and risk task
- Hoping AI will fill gaps in the data — in practice it only amplifies them
Criteria for decision-making
- Data maturity: does the bank have credit history of sufficient volume and quality to learn on
- Explainability: can the bank explain a specific decision — to the customer, auditor and regulator — within the chosen approach
- Task: is it a high-throughput decision where speed matters, or a long decision where the argument matters
- Governance maturity: does the bank have a culture of model ownership, monitoring and retraining
- Infrastructure: can the current architecture serve the scoring engine at the required pace
- Cost: is the accuracy gain comparable to the cost of implementing and maintaining a more complex model
- Change management: how quickly can the bank update the model and deploy the change if risk management or the regulator asks
